Abstract—The results of anomaly detection are sensitive to the choice of detection
algorithmsastheyarespecializedfordifferentpropertiesofdata,
especiallyformultidimensionaldata.Thus,itisvitaltoselectthealgorithmappropriately.
Tosystematicallyselectthe algorithms, ensemble analysis techniques have been developed to support
the assembly and comparison of heterogeneous algorithms. However, challenges
remainduetotheabsenceofthegroundtruth,interpretation,or
evaluationoftheseanomalydetectors.Inthispaper,
wepresentavisualanalyticssystemnamedEnsembleLensthatevaluatesanomalydetectionalgorithmsbase
dontheensemble analysis process. The system visualizes the ensemble processes and results by a set
of novel visual designs and multiple coordinated contextual views to meet the requirements of
correlation analysis, assessment and reasoning of anomaly detection algorithms. We also introduce an
interactive analysis workflow that dynamically produces contextualized and interpretable data
summaries that allow further refinements of exploration results based on user feedback. We
demonstrate the effectiveness of EnsembleLens through a quantitative evaluation, three case studies

basic knowledge about deep learning models, focusing on convolutional neural networks and recurrent
neural networks Deep learning models usually refer to neural networks with multiple hidden layers of
neurons between the input and output layers (Bengio, 2009). A deep neural network (DNN) is a typical deep
learning model. As shown in Figure 3.1, the leftmost layer is called the input layer; the rightmost layer is
called the output layer; the middle layer is called the hidden layer. We call a node in the network a neuron or
unit, just like a biological neuron. It performs a scalar product with its input and weights, added by the bias
and then the result is applied with an activation function (Figure 3.2). The final value of the neuron is called
as an activation and a vector of activations in a hidden layer is a representation of an original input.
Convolutional Neural Networks Recurrent Neural Networks
Recurrent Neural Networks are another special type of network with a loop, which are usually used for
handling sequential data. Here we introduce some important characteristics of an RNN. Where f is a
non-linear function, such as a tanh function and a ReLU function. It is generally believed that RNNs have a
memory which can capture information calculated before, but they have only very limited memory due to the
gradient vanish or explode problem, which can only look back a few steps. LSTMs. Long Short Term Memory
networks (LSTMs) are special kinds of RNNs, which use long short-term cells to help the learning of
long-term dependencies in RNNs. As shown in Figure 3.5, Figure 3.5(a) is a standard RNN, while Figure 3.5(b)

visualizing the process of deep learning models. In general, neural networks can be categorized by their

Neural Networks (RNNs) and Deep Belief Networks (DBNs). Among them, CNNs and RNNs are the most
widely used and have achieved numerous state-of-the-art results. To the best of our knowledge, many
existing work about visualization is being applied to these two architectures owing to their prevalence and
practicality. Therefore, in this survey, our examples are mostly related to these two architectures, especially
for CNNs.
Finally, we give a table summarizing the related papers in this survey (Table 2.1).

understood; developing methods that generate explanations for already complicated classifiers. Based on the
life circle of a classifier, we discuss the pioneering work of using visualization to improve its explainability at
different stages in the life circle. The survey ends with a discussionabout the challenges and future research
opportunities of explainable classifiers.
With the increasing computer capacity, the use of Bayesian Nets in the decision making process of
venture capital firms is applicable. This can greatly increase the efficiency of the process to search for
potential unicorn investments since the computer can analyze one company faster than a human.
However, there is much more noise that the computer for because the data set of new firms is
constantly increasing (137.000 new companies each day, as noted above). A human can easier focus
on a specific target, or get additional information that the computer cannot by talking to business
acquaintances in start-up hubs. This is important to consider since the venture capital industry is a

EventThread: Visual Summarization and Stage Analysis of Event Sequence Data
EventThread system summarizes event sequence data into threads that are segmented into stages and
clustered into latent stage categories, thus showing the evolution patterns of the event sequences. Thisfigure
shows different car maintenance patterns analyzed based on car service records consists of 66 individual car
maintenance events in 6 distinct event types. This figure illustrates cars use full-synthetic or premium oil
usually have a better condition when compared with the cars use semi-synthetic oil.
Abstract— Event sequence data such as electronic health records, a person’s academic records, or car
servicerecords,areorderedseriesofeventswhichhaveoccurredoveraperiodoftime.
Analyzingcollectionsofeventsequencescanrevealcommonorsemanticallyimportantsequential patterns. For
example, event sequence analysis might reveal frequently used care plans for treating a disease, typical
publishing patterns of professors, and the patterns of service that result in a well-maintained car. It is
challenging, however, to visually explore large numbers of event sequences, or sequences with large numbers
of event types. Existing methods focus on extracting explicitly matching patterns of events using statistical
analysis to create stages of event progression over time. However, these methods fail to capture latent clusters
of similar but not identical evolutions of event sequences. In this paper, we introduce a novel visualization
system named EventThread which clusters event sequences into threads based on tensor analysis and
visualizes the latent stage categories and evolution patterns by interactively grouping the threads by similarity
into time-specific clusters. We demonstrate the effectiveness of EventThread through usage scenarios in three
different application domains and via interviews with an expert user. Index Terms—Visual Knowledge

A deep neural network (DNN) is a typical deep learning model. As shown in Figure 3.1, the leftmost layer is called the input layer; the rightmost layer is called the output layer; the middle layer is called the hidden layer. We call a node in the network a neuron or unit, just like a biological neuron. It performs a scalar product with its input and weights, added by the bias and then the result is applied with an activation function (Figure 3.2). The final value of the neuron is called as an activation and a vector of activations in a hidden layer is a representation of an original input. Convolutional Neural Networks Recurrent Neural Networks Recurrent Neural Networks are another special type of network with a loop, which are usually used for handling sequential data. Here we introduce some important characteristics of an RNN. Where f is a non-linear function, such as a tanh function and a ReLU function. It is generally believed that RNNs have a memory which can capture information calculated before, but they have only very limited memory due to the gradient vanish or explode problem, which can only look back a few steps. LSTMs. Long Short Term Memory networks (LSTMs) are special kinds of RNNs, which use long short-term cells to help the learning of long-term dependencies in RNNs. As shown in Figure 3.5, Figure 3.5(a) is a standard RNN, while Figure 3.5(b) is a LSTM. The main difference is about the calculation of the hidden state, where three gates (input gate, forget gate and output gate) are introduced into LSTM. Among them, CNNs and RNNs are the most widely used and have achieved numerous state-of-the-art results. To the best of our knowledge, many existing work about visualization is being applied to these two architectures owing to their prevalence and practicality. Therefore, in this survey, our examples are mostly related to these two architectures, especially for CNNs. Finally, we give a table summarizing the related papers in this survey (Table 2.1). Inpractice,interpretabilityisadesirablepropertyofclassificationmodels(classifiers)incriticalareas, such as security, medicine, and finance. Unfortunately,thebest-performingclassifiersinmanyapplications(e.g.,deep neuralnetworks)arecomplexmodelswhosepredictionsaredifficulttoexplain. Thus,there is a growinginterestinusingvisualizationtounderstand,diagnoseandexplainintelligent systemsinbothacademiaandindustry.Manychallengesneedtobeaddressedintheformalizationof explainability, and the design principles and evaluation of explainable intelligent systems. The survey starts with an introduction to the concept and background of explainable classifiers. Efforts towards more explainable classifiers are categorized into two types: designing classifiers with simpler structures that can be easily understood; developing methods that generate explanations for already complicated classifiers. Based on the life circle of a classifier, we discuss the pioneering work of using visualization to improve its explainability at different stages in the life circle. The survey ends with a discussionabout the challenges and future research opportunities of explainable classifiers. With the increasing computer capacity, the use of Bayesian Nets in the decision making process of venture capital firms is applicable. This can greatly increase the efficiency of the process to search for potential unicorn investments since the computer can analyze one company faster than a human. However, there is much more noise that the computer for because the data set of new firms is constantly increasing (137.000 new companies each day, as noted above). A human can easier focus on a specific target, or get additional information that the computer cannot by talking to business acquaintances in start-up hubs. This is important to consider since the venture capital industry is a fact-paced industry, where it is crucial to find these unicorns before your competitors. A computer, on the other hand, can easier find unicorns that the human would not, e.g. companies outside of these hubs. Fundamentals of Artificial Intelligence With the use of Bayesian Networks in the decision making process, instead of the traditional approach, reduces the biases that the human mind often consider, such as you can have a bias toward a specific sector because you find it more interesting. There are several aspects to take into consideration for further research within this subject. For an exampel, we could extend to investigate the use of neural networks, as EQT did with Motherbrain and then compare these two algorithm and their performance. For example, event sequence analysis might reveal frequently used care plans for treating a disease, typical publishing patterns of professors, and the patterns of service that result in a well-maintained car. It is challenging, however, to visually explore large numbers of event sequences, or sequences with large numbers of event types. Existing methods focus on extracting explicitly matching patterns of events using statistical analysis to create stages of event progression over time. However, these methods fail to capture latent clusters of similar but not identical evolutions of event sequences. In this paper, we introduce a novel visualization system named EventThread which clusters event sequences into threads based on tensor analysis and visualizes the latent stage categories and evolution patterns by interactively grouping the threads by similarity into time-specific clusters. We demonstrate the effectiveness of EventThread through usage scenarios in three different application domains and via interviews with an expert user.
