Zipline is Airbnb’s data management platform specifically designed for ML use cases. Previously, ML practitioners at Airbnb spent roughly 60% of their time on collecting and writing transformations for machine learning tasks. Zipline reduces this task from months to days – by making the process declarative. It allows data scientists to easily define features in a simple configuration language. The framework then provides access to point-in-time correct features – for both – offline model training and online inference. In this talk we will describe the architecture of our system and the algorithm that makes the problem of efficient point-in-time correct feature generation, tractable. The attendee will learn Importance of point-in-time correct features for achieving better ML model performance Importance of using change data capture for generating feature views An algorithm – to efficiently generate features over change data. We use interval trees to efficiently compress time series features. The algorithm allows generating feature aggregates over this compressed representation. A lambda architecture – that enables using the above algorithm – for online feature generation. A framework, based on category theory, to understand how feature aggregations be distributed, and independently composed. While the talk if fairly technical – we will introduce all the concepts from first principles with examples. Basic understanding of data-parallel distributed computation and machine learning might help, but are not required.

Hive tables are an integral part of the big data ecosystem, but the simple directory-based design that made them ubiquitous is increasingly problematic. Netflix uses tables backed by S3 that, like other object stores, don’t fit this directory-based model: listings are much slower, renames are not atomic, and results are eventually consistent. Even tables in HDFS are problematic at scale, and reliable query behavior requires readers to acquire locks and wait. Owen O’Malley and Ryan Blue offer an overview of Iceberg, a new open source project that defines a new table layout addresses the challenges of current Hive tables, with properties specifically designed for cloud object stores, such as S3. Iceberg is an Apache-licensed open source project. It specifies the portable table format and standardizes many important features, including: * All reads use snapshot isolation without locking. * No directory listings are required for query planning. * Files can be added, removed, or replaced atomically. * Full schema evolution supports changes in the table over time. * Partitioning evolution enables changes to the physical layout without breaking existing queries. * Data files are stored as Avro, ORC, or Parquet. * Support for Spark, Pig, and Presto.

Lambda architecture is a popular technique where records are processed by a batch system and streaming system in parallel. The results are then combined during query time to provide a complete answer. Strict latency requirements to process old and recently generated events made this architecture popular. The key downside to this architecture is the development and operational overhead of managing two different systems. There have been attempts to unify batch and streaming into a single system in the past. Organizations have not been that successful though in those attempts. But, with the advent of Delta Lake, we are seeing lot of engineers adopting a simple continuous data flow model to process data as it arrives. We call this architecture, The Delta Architecture.

Eric Hanson and I gave this presentation at Hadoop Summit 2013: Hive’s RCFile has been the standard format for storing Hive data for the last 3 years. However, RCFile has limitations because it treats each column as a binary blob without semantics. Hive 0.11 added a new file format named Optimized Row Columnar (ORC) file that uses and retains the type information from the table definition. ORC uses type specific readers and writers that provide light weight compression techniques such as dictionary encoding, bit packing, delta encoding, and run length encoding — resulting in dramatically smaller files. Additionally, ORC can apply generic compression using zlib, LZO, or Snappy on top of the lightweight compression for even smaller files. However, storage savings are only part of the gain. ORC supports projection, which selects subsets of the columns for reading, so that queries reading only one column read only the required bytes. Furthermore, ORC files include light weight indexes that include the minimum and maximum values for each column in each set of 10,000 rows and the entire file. Using pushdown filters from Hive, the file reader can skip entire sets of rows that aren’t important for this query. Columnar storage formats like ORC reduce I/O and storage use, but it’s just as important to reduce CPU usage. A technical breakthrough called vectorized query execution works nicely with column store formats to do this. Vectorized query execution has proven to give dramatic performance speedups, on the order of 10X to 100X, for structured data processing. We describe how we’re adding vectorized query execution to Hive, coupling it with ORC with a vectorized iterator.

Netflix’s playback data records every user interaction with video on the service, from trailers on the home page to full-length movies. This is a critical dataset with high volume that is used broadly across Netflix, powering product experiences, AB test metrics, and offline insights. In processing playback data, we depend heavily on event-time partitioning to handle a long tail of late arriving events. In this talk, I’ll provide an overview of our recent implementation of generic event-time partitioning on high volume streams using Apache Flink and Apache Iceberg (Incubating). Built as configurable Flink components that leverage Iceberg as a new output table format, we are now able to write playback data and other large scale datasets directly from a stream into a table partitioned on event time, replacing the common pattern of relying on a post-processing batch job that “puts the data in the right place”. We’ll talk through what it took to apply this to our playback data in practice, as well as challenges we hit along the way and tradeoffs with a streaming approach to event-time partitioning.

In data analytics frameworks such as Spark it is important to detect and avoid scanning data that is irrelevant to the executed query, an optimization which is known as partition pruning. Dynamic partition pruning occurs when the optimizer is unable to identify at parse time the partitions it has to eliminate. In particular, we consider a star schema which consists of one or multiple fact tables referencing any number of dimension tables. In such join operations, we can prune the partitions the join reads from a fact table by identifying those partitions that result from filtering the dimension tables. In this talk we present a mechanism for performing dynamic partition pruning at runtime by reusing the dimension table broadcast results in hash joins and we show significant improvements for most TPCDS queries.

In the past when Hadoop was born, the big data world were focusing on how to build systems that scales. Now the world has evolved. HBase hits 2.0, Cassandra hits 3.0, Hive hits 3.0, etc. When scalability is conquered, what's next? That’s right, usability comes into play. If we look back into the history, NoSQL is really just using divide and concur mechanism to tackle big data problems by trading off SQL capabilities. But once big data problem solved, we see more and more NoSQL and data processing engines start to build up SQL or SQL-like interfaces. Therefore, a generic SQL engine that provides core SQL capabilities such as query parsing, relational algebra, and query optimization starts to shine. In this talk, I'll walk you through the architecture, functionality, and design concept of Apache Calcite. Notice that Calcite itself is not a database, but many well known systems already incorporate Calcite as a library. For instance, Hive, Drill, Druid, Phoenix, Apex, Flink, Storm, Samza, and more. To better illustrate how Calcite works, I'll choose some of the systems and describe how they adopt Calcite and which part is enhanced by Calcite. Furthermore, I'll talk about several features that Calcite provides such as query optimization, heterogeneous data source, materialized view, and Stream SQL. From user's perspective, knowing better how these systems work behind the scene equips you with more knowledge to chose a system that ultimately suits your needs.
