Banks are innovating. The purpose of this innovation is to transform bank services into meaningful and frictionless customer experiences. A key element in order to achieve that ambitious goal is by providing well tailored and reactive APIs and provide them as the building blocks for greater and smoother customer journeys and experiences. For these API’s to work, internal processes have to evolve as well from batch processing to real time event processing. In this talk, after providing a brief introduction of the streaming computing landscape, we describe a RESTful API called “Coral” meant to design and deploy customized and flexible data flows. The user can compose data flow for a number of data streaming goals such as on-the-fly data clustering and classifiers, streaming analytics, per-event predictive analysis , real time recommenders. Once the events are processed, Coral passes the resulting analysis as auctionable events for alerting, messaging or further processing to other systems. Coral is a flexible and generic event processing platform to transform streaming data into actionable events via a RESTful API. Those data flows are defined via the Web API by connecting together basic streaming processing elements named “coral actors”. The Coral framework manages those coral actors on a distributed and scalable architecture. Streaming and real time data processing and analytics are the key elements to an improved customer experience. In this way, you can get the most targeted processing for your domain (marketing customization, personalized recommenders, fraud detection, real time security alerting, etc.). This streaming “data flow” model implies processing customers’ events as soon as they enter via web APIs. This approach borrows a lot from distributed “data flow” concepts developed for processor architectures back in the 80’s. The “Coral” streaming processing engine is generic and built on top of world class libraries such as Akka and Spark, and fully exposed via a RESTful web API.

A high performing search service implies both having an effective search infrastructure and high search relevance. Seeking for a fault tolerant, self-healing and cost-effective search infrastructure at scale, we built a platform based on Apache Solr search engine with light in-memory indexes, avoiding sharding and decreasing the overall infrastructure needs. To populate the indexes, we use flexible ETL processes, keeping our product catalog and search indexes updated in a near real-time fashion and distributed across high-performant database engines. Upwork has the biggest closed-loop online dataset of jobs and job seekers in labor history (>10M Profiles, >100M Job Posts, Job Proposals and Hiring Decisions, >10B of Messages, Transaction and Feedback Data). Besides sheer quantity, our data is also contextually very rich. We have client and contractor data for the entire job-funnel – from finding jobs to getting the job done. For various machine learning applications including search and recommendations and labor marketplace optimization (rate, supply and demand), we heavily relied on a Greenplum-based data warehouse solution for data processing and ad-hoc ML pipelines (weka, scikit-learn, R) for offline model development and online model scoring. In this talk, we present our modernization efforts in moving towards a 1) holistic data processing infrastructure for batch and stream data processing using S3, Kinesis, Spark and Spark Structured Streaming 2) model development using Spark MLlib and other ML libraries for Spark 3) model serving using Databricks Model Scoring, Scoring over Structured Streams and microservices and 3) how we orchestrate and streamline all these processes using Apache Airflow and a CI/CD workflow customized to our Data Science product engineering needs. The focus of this talk is on how we were able to leverage the Databricks service offering to reduce DevOps overhead and costs, complete the entire modernization with moderate efforts and adopt a collaborative notebook-based solution for all our data scientists to develop model, reuse features and share results. We will shared the core lessons learned and pitfalls we encountered during this journey.

Other industries—retail, healthcare, government, financial services, energy, and more—also lean into Industry 4.0 technology to take advantage of IoT devices, sensors, smart machines, robotics, and connected data. Spark Streaming has supported Kafka since it's inception, but a lot has changed since those times, both in Spark and Kafka sides, to make this integration more fault-tolerant and reliable.Apache Kafka 0.10 (actually since 0.9) introduced the new Consumer API, built on top of a new group coordination protocol provided by Kafka itself. So a new Spark Streaming integration comes to the playground, with a similar design to the 0.8 Direct DStream approach. However, there are notable differences in usage, and many exciting new features. In this talk, we will cover what are the main differences between this new integration and the previous one (for Kafka 0.8), and why Direct DStreams have replaced Receivers for good. We will also see how to achieve different semantics (at least one, at most one, exactly once) with code examples. Finally, we will briefly introduce the usage of this integration in Billy Mobile to ingest and process the continuous stream of events from our AdNetwork.

Streaming Data Ingest and Processing with Apache Kafka

While systems like Apache Spark have moved beyond a simple map-reduce model, many data scientists and scientific users still struggle with complex cluster management and configuration tools when trying to do data processing in the cloud. Recently, cloud providers have offered infrastructure such as AWS Lambda to run event-driven, stateless functions as micro-services. In this model, a function is deployed once and is invoked repeatedly whenever new inputs arrive and elastically scales with input size. In this session, the speakers claim that microservices on serverless infrastructure present a viable platform for eliminating cluster management overhead and fulfilling the promise of elasticity in cloud computing for all users. Their key insight is that they can dynamically inject code into these stateless functions and, combined with remote storage, they can build a data processing system that inherits the elasticity of the serverless model while addressing the simplicity required by end users. Using PyWren, their implementation on AWS Lambda, they show that this model is general enough to implement a number of distributed computing models, such as BSP, efficiently. Learn about a number of scientific and machine learning applications that they have built with PyWren, and how this model could be used to develop a serverless-Spark in the future.

After a quick overview and introduction of Apache Kafka, this session cover two components which extend the core of Apache Kafka: Kafka Connect and Kafka Streams/KSQL. Kafka Connects role is to access data from the out-side-world and make it available inside Kafka by publishing it into a Kafka topic. On the other hand, Kafka Connect is also responsible to transport information from inside Kafka to the outside world, which could be a database or a file system. There are many existing connectors for different source and target systems available out-of-the-box, either provided by the community or by Confluent or other vendors. You simply configure these connectors and off you go. Kafka Streams is a light-weight component which extends Kafka with stream processing functionality. By that, Kafka can now not only reliably and scalable transport events and messages through the Kafka broker but also analyse and process these event in real-time. Interestingly Kafka Streams does not provide its own cluster infrastructure and it is also not meant to run on a Kafka cluster. The idea is to run Kafka Streams where it makes sense, which can be inside a “normal” Java application, inside a Web container or on a more modern containerized (cloud) infrastructure, such as Mesos, Kubernetes or Docker. Kafka Streams has a lot of interesting features, such as reliable state handling, queryable state and much more. KSQL is a streaming engine for Apache Kafka, providing a simple and completely interactive SQL interface for processing data in Kafka.

A Feature Store enables machine learning (ML) features to be registered, discovered, and used as part of ML pipelines, thus making it easier to transform and validate the training data that is fed into machine learning systems. Feature stores can also enable consistent engineering of features between training and inference, but to do so, they need a common data processing platform. The first Feature Stores, developed at hyperscale AI companies such as Uber, Airbnb, and Facebook, enabled feature engineering using domain specific languages, providing abstractions tailored to the companies’ feature engineering domains. However, a general purpose Feature Store needs a general purpose feature engineering, feature selection, and feature transformation platform. In this talk, we describe how we built a general purpose, open-source Feature Store for ML around dataframes and Apache Spark. We will demonstrate how data engineers can transform and engineers features from backend databases and data lakes, while data scientists can use PySpark to select and transform features into train/test data in a file format of choice (.tfrecords, .npy, .petastorm, etc) on a file system of choice (S3, HDFS). Finally, we will show how the Feature Store enables end-to-end ML pipelines to be factored into feature engineering and data science stages that each can run at different cadences. Bio: Fabio Buso is the head of engineering at Logical Clocks AB, where he leads the Feature Store development. Fabio holds a master's degree in cloud computing and services with a focus on data intensive applications, awarded by a joint program between KTH Stockholm and TU Berlin. It serves as an abstraction layer between other M&O layers and the underlying physical hardware. The real take-away is that physical infrastructure provisioning can be consumed and managed by other orchestration tools. This elevates the understanding of the underlying infrastructure to a new layer. It allows tools to start consuming physical infrastructure in the same way that we used to consume virtual machines.
